I spent 2 hours recently reviewing quarterly AI project reports. Demo after demo looked impressive. Business cases appeared compelling. Success metrics seemed strong.
Then someone asked about operational costs.
As one engineering leader recently shared on Reddit, the reality behind these AI success stories is often brutal. A six-month proof of concept built by five data scientists and a UX designer had created an impressive demo: one that required 75 seconds to generate responses, fired nearly 50 repetitive queries per request, and would cost $1.2 million annually to save employees fifteen minutes per day. The project was quietly shelved after a thorough technical review revealed what the POC phase had overlooked: building something useful with AI requires more than clever prompts and optimism.
This failure represents the fundamental shift CTOs must make in the AI era. Sam Altman captured it when he said the race has moved from benchmarks toward “who’s using the model and who’s getting the value out of it.” Technical excellence alone cannot guarantee AI product success. Yet most technology leaders continue approaching AI initiatives like infrastructure projects instead of products, optimizing for performance metrics while ignoring the human adoption patterns that determine commercial viability.
The gap between impressive demos and sustainable business value has become the defining challenge of enterprise AI. This represents a leadership problem requiring CTOs to fundamentally re-learn how software development lifecycle processes work in an AI-driven world.
Why Engineering-Led AI Projects Fail
Today someone asked me why we see so many AI projects fail after successful POCs. The question took me by surprise because this is the first time I’ve seen the pattern articulated so clearly.
The root cause? Teams build technically sophisticated AI systems that users actively avoid. This happens because we persist in applying traditional engineering thinking to a technology that succeeds or fails based on human behavior.
Consider the mindset differences that doom projects from inception:
Engineering-led thinking asks: “Does the AI work as designed? Can we build this technically?”
Product-minded thinking asks: “Will users adopt this? Does it solve problems they actually experience?”
Gregor Hohpe’s concept of the Architect Elevator becomes crucial at this point. CTOs must move fluidly between the technical engine room and the business penthouse, translating between these worlds. But most technology leaders get stuck in the basement, perfecting technical specifications while business stakeholders make adoption decisions based on entirely different criteria.
The AI reality proves unforgiving: success depends on re-learning the entire software development lifecycle. Traditional SDLC approaches optimize for predictable requirements and stable user interfaces. AI systems require continuous learning loops, user feedback integration, and adaptive deployment strategies that most engineering teams have yet to develop.
This creates the failure pattern we see repeatedly: teams deliver technically impressive demos that users reject because the development process never accounted for human workflow integration, trust building, or value demonstration. The technology works perfectly according to engineering metrics while failing completely according to business metrics.
And this is why I think the whole approach needs to change.
The CTO-to-PM Mindset Transformation Framework
I am convinced we should use what I call the alchemist-to-builder transformation for AI projects. Let me explain why this matters.
The SDLC will eventually evolve around two key personas. Early AI initiatives operate in alchemist mode: experimental, exploratory, focused on discovering what remains possible. We have been chasing the vision of creating prototypes quickly and gathering user feedback for a while, and we have continually struggled. So many of us have ideas we want to communicate, but we are stuck finding ways to validate them quickly and cost-effectively.
But scaling AI requires builder thinking: systematic, user-centered, focused on creating sustainable value. Since the rise of specialized roles, we are heading back to the ways of working from two decades ago. This will happen when we have fully merged these stages and truly achieve product-market fit with AI solutions.
Most CTOs excel at alchemist mode but struggle with the builder transition. The challenge becomes knowing when to stop experimenting and commit to a scalable approach.
This transformation starts with replacing engineering metrics with adoption metrics. Instead of measuring model accuracy, track user task completion rates. Instead of optimizing processing speed, measure time-to-value for actual workflows. Instead of counting feature completeness, measure workflow integration depth.
These represent fundamentally different success criteria. Agile development recognized this shift decades ago, prioritizing working software over comprehensive documentation. AI development requires the same philosophical commitment: working adoption over perfect algorithms.
If you look at this approach, it basically suggests that by focusing on adoption metrics instead of technical specifications we save time. There is less of a handshake between what engineering builds and what business actually needs.
The practical framework involves three core measurement shifts:
First, replace technical benchmarks with user engagement metrics. Daily active users matter more than model precision scores. Feature stickiness indicates value better than processing speed. User retention reveals adoption patterns that technical metrics cannot capture.
Second, implement business outcome tracking that connects AI performance to organizational objectives. Revenue impact measurement, cost reduction analysis, and ROI calculations become primary success indicators. The $1.2 million failure happened because the team measured technical success while ignoring economic reality.
Third, restructure teams to embed product management thinking throughout AI development. Cross-functional decision-making between engineering and business stakeholders prevents the communication breakdowns that kill projects after technical completion.
The model works. The cost savings are there.
Setting Product-Focused KPIs for AI Success
While the idea of technical KPIs was great, most organizations forgot that performance metrics never got the traction they expected for measuring AI success.
Traditional KPI frameworks fail for AI because they measure system performance rather than human adoption. The transformation requires replacing engineering-centric metrics with business-outcome indicators that reflect real-world usage patterns.
Given how technical metrics are perceived, the whole use case that most organizations prescribe fails. Technical accuracy means nothing if users refuse to trust the results enough to act on them.
The KPI framework should track four primary dimensions:
User engagement metrics reveal adoption patterns: daily active users, feature usage frequency, and task completion rates indicate whether people find genuine value.
Business impact indicators measure organizational outcomes: time savings, cost reduction, revenue generation, and productivity improvements that justify continued investment.
Trust and reliability metrics become crucial for AI systems in ways they never were for traditional software. User confidence scores, override rates, and error correction patterns reveal whether people trust the system enough to integrate it into critical workflows.
Competitive differentiation tracking measures sustainable advantage creation. Market positioning relative to alternatives, user retention compared to competitor solutions, and switching cost development indicate whether AI initiatives create defensible business value beyond temporary technical superiority.
By now you would have figured where I am going with this. User adoption has traction and business stakeholders embrace learning these metrics naturally. What most organizations wanted from technical KPIs is what adoption metrics actually deliver.
Communicating AI Value and Building Competitive Advantage
I recently made a decision to change how we communicate AI project value after watching another technically successful project get killed during budget reviews.
The communication challenge that killed the $1.2 million project illustrates why technical excellence fails to translate to business success. Technical teams naturally speak in algorithms and accuracy percentages. Business stakeholders think in outcomes and return on investment. The gap between these languages creates the “already agreed with business (it was never agreed)” breakdowns that doom projects after significant investment.
Effective stakeholder communication requires different value propositions for different audiences:
Executives need business cases focused on competitive advantage and strategic positioning. They want to understand how AI initiatives create sustainable market differentiation.
Business unit leaders need workflow integration stories showing productivity gains and user experience improvements.
Finance teams need cost-benefit analysis with clear operational expense projections and break-even timelines.
The communication framework must translate technical AI capabilities into business value propositions that resonate with each stakeholder group.
Sustainable competitive advantage in AI comes from product thinking, rather than technical specifications. While competitors chase benchmarks, product-focused teams win through user adoption and business process integration. User experience moats develop when AI feels familiar and trustworthy rather than impressive and intimidating. Business process integration creates switching costs as AI becomes embedded in critical workflows.
Trust and adoption networks generate organic expansion as satisfied users become internal advocates. Data feedback loops improve AI performance through actual usage patterns rather than synthetic training scenarios.
The market positioning strategy should emphasize explainable AI architecture and trust-building approaches as the industry moves toward natural language programming interfaces. Companies mastering human-AI collaboration patterns gain sustainable advantages while others focus on raw technical performance.
Your 90-Day Transformation Playbook
When working with AI and given the direction the industry is taking, using product-minded approaches is the way to go. Even when we are building traditional enterprise applications, we can still benefit greatly from the time savings we get from adopting product thinking throughout the development process.
Implementation requires systematic progression through three phases, each building capability for the next stage.
Phase 1 (Days 1–30): Adopt Product Evaluation Methods
Audit current AI projects using business metrics rather than technical benchmarks. Implement user feedback collection systems that capture adoption friction and value perception. Establish baseline measurements for user engagement, business impact, and trust indicators. This phase reveals the gap between technical performance and business value in existing initiatives.
Phase 2 (Days 31–60): Restructure with Product Processes
Embed product management thinking in AI development workflows. Replace engineering roadmaps focused on technical milestones with user value roadmaps prioritizing adoption drivers. Implement stakeholder communication frameworks that translate technical capabilities into business outcomes. This phase builds organizational capability for product-minded AI development.
Phase 3 (Days 61–90): Scale Product Thinking
Train technical teams on user-centered AI development methodologies. Establish product success criteria for all AI initiatives before technical development begins. Build competitive advantages through adoption optimization and workflow integration rather than algorithmic improvement. This phase creates systematic capability for sustainable AI value creation.
Each phase includes specific deliverables and success metrics that ensure progress toward product-minded AI leadership. The playbook provides actionable steps rather than abstract frameworks, recognizing that transformation requires concrete behavioral changes.
The model works. The cost savings are there. And there is a need to commit to one approach rather than mixing technical and product thinking.
